The second module uses something called a recurrent neural network, another type of deep net designed to uncover patterns in inputs that come sequentially. What it’s basically doing is predicting the next word in a sequence based on statistics it has gleaned from millions of text documents. A well-trained neural network might be able to detect the baseball, the bat, and the player in the video at the beginning of this article. But it will be hard-pressed to make sense of the behavior and relation of the different objects in the scene. Neural networks also start to break when they deal with novel situations that are statistically different from their training examples, such as viewing an object from a new angle.

Computers see visual data as patches of pixels, numerical values that represent colors of points on an image. The naïve approach to solving this problem with symbolic AI would be to create a rule-based system that compares the pixel values in an image against a known sequence of pixels for a specific object. The problem with this approach is that the pixel values of an object will be different based on the angle it appears in an image, the lighting conditions, and if it’s partially obscured by another object. We tuned four language models using our symbol-tuning procedure, utilizing a tuning mixture of 22 datasets and approximately 30K arbitrary symbols as labels. Narrow AI systems are good at performing a single task, or a limited range of tasks. But as soon as they are presented with a situation that falls outside their problem space, they fail.

But distilling human expertise into a set of rules and facts turns out to be very difficult, time-consuming and expensive. This was called the “knowledge acquisition bottleneck.” While simple to program rules for math or logic, the world itself is remarkably ambiguous, and it proved impossible to write rules governing every pattern or define symbols for vague concepts. The answers might change our understanding of how intelligence works and what makes humans unique. These two approaches, responsible for creative thinking and logical reasoning respectively, work together to solve difficult mathematical problems.

Various AI algorithms then return new content in response to the prompt. Content can include essays, solutions to problems, or realistic fakes created from pictures or audio of a person. Symbols are also more conducive to formal verification techniques, which are critical for some aspects of safety and ubiquitous in the design of modern microprocessors. To abandon these virtues rather than leveraging them into some sort of hybrid architecture would make little sense. It took until the 2010s for the power of neural networks trained via backpropagation to truly make an impact. Working with a couple of graduate students, Hinton showed that his technique was better than any others at getting a computer to identify objects in images. They also trained a neural network to predict the next letters in a sentence, a precursor to today’s large language models. Hinton is best known for his work on a technique called backpropagation, which he proposed (with a pair of colleagues) in the 1980s.

Consider, for instance, the following set of pictures, which all contain basketballs. It is clear in the images that the pixel values of the basketball are different in each of the photos. AI, as envisioned by McCarthy and his colleagues, is an artificial intelligence system that can learn tasks and solve problems without being explicitly instructed on every single detail. It should be able to do reasoning and abstraction, and easily transfer knowledge from one domain to another. Of course, one can easily imagine an AI system that is pure software intellect, so to speak, so how do LLMs shape up when compared to the mental capabilities listed above?

This problem is not just an issue with GenAI or neural networks, but, more broadly, with all statistical AI techniques. A huge language model might be able to generate a coherent text excerpt or translate a paragraph from French to English. But it does not understand the meaning of the words and sentences it creates.

Generative AI could also play a role in various aspects of data processing, transformation, labeling and vetting as part of augmented analytics workflows.
